Open table formats have transformed analytical storage, but the performance of a lakehouse increasingly depends on metadata architecture, maintenance, and workload-aware data organization.
The Lakehouse Solved One Problem and Exposed Another
The modern data lakehouse emerged from a compelling idea: combine the flexibility and economics of object storage with the reliability and management capabilities traditionally associated with data warehouses.
Technologies such as Apache Iceberg, Delta Lake, and Apache Hudi provide capabilities for managing large analytical tables, including transactional updates, schema evolution, and metadata-driven access.
These capabilities have made lakehouse architectures practical for a growing range of enterprise workloads.
Yet, a lakehouse can become difficult to operate even when its underlying object storage scales almost without limit.
Queries slow down. Planning takes longer. Small files accumulate. Maintenance jobs compete with analytical workloads. Metadata grows, and operational costs become harder to predict.
The problem is not necessarily insufficient compute.
It may be the increasing cost of discovering, planning, maintaining, and interpreting the data itself.
Storage Scalability Is Not Query Scalability
Object storage is designed to hold enormous volumes of data.
That does not mean every layout of that data is equally efficient to query.
Imagine a table containing several terabytes of transactional records.
One version stores the data in appropriately sized columnar files organized around common query patterns. Another stores the same logical records across hundreds of thousands of small files.
Both datasets may occupy similar logical storage capacity.
But their query-planning and execution characteristics can differ substantially.
The second layout may require more file metadata, more object operations, additional task scheduling, and less efficient scans.
This illustrates an important distinction: data volume alone does not determine lakehouse performance.
File count, partition distribution, metadata structure, delete-file accumulation, and query selectivity also matter.
1. Small Files Are an Architectural Problem
Small files are often created by continuous ingestion, frequent micro-batches, highly granular partitioning, and distributed writers producing many outputs.
A platform can write data successfully while gradually creating a layout that is expensive for downstream readers.
Compaction can help by combining files into more efficient units.
But compaction itself consumes compute and I/O.
It also needs to respect concurrency, table-format semantics, and the behavior of active readers and writers.
This makes file maintenance an economic decision, not simply a background housekeeping task.
A useful operating question is whether the reduction in future query cost justifies the immediate maintenance cost.
2. Metadata Is Part of the Execution Path
Apache Iceberg uses table metadata and manifests to describe snapshots and data files. Delta Lake uses a transaction log and checkpoints to manage table state.
These structures provide capabilities that would be difficult to implement reliably using an unmanaged directory of files.
They also introduce metadata lifecycle responsibilities.
As tables evolve, teams need to consider snapshot retention, manifest organization, transaction-log maintenance, metadata cleanup, and the interaction between readers and writers.
Metadata should therefore be treated as performance-critical infrastructure.
It determines not only what data exists, but also how efficiently a query engine can identify the data it needs.
3. Partitioning Can Become a Liability
Partitioning improves performance when it helps a query avoid irrelevant data.
But excessive partition granularity can create operational problems.
Suppose a dataset is partitioned by a combination of date, store, region, and another high-cardinality attribute.
If many combinations contain very little data, the system may produce numerous small files and partitions.
The resulting metadata and file-management costs can outweigh the benefit of pruning.
The correct partitioning strategy depends on query patterns, data distribution, update frequency, and table-format capabilities.
A partitioning scheme should be evaluated against actual workload characteristics rather than chosen only because the columns appear useful for filtering.
4. Retention and Cleanup Require Correctness Guarantees
Lakehouse maintenance introduces another important challenge: removing data safely.
Snapshot expiration and orphan-file cleanup can reclaim storage, but poorly configured retention can interfere with long-running readers, rollback requirements, or concurrent operations.
Maintenance must respect the table format's rules and the organization's recovery expectations.
Storage reclamation should never be treated as a simple directory deletion operation.
The platform needs a clear understanding of which files are still referenced, which snapshots remain necessary, and when physical deletion is safe.
A Workload-Aware Lakehouse Maintenance Framework
I propose evaluating maintenance decisions through five signals:
|
Signal |
What it reveals |
|---|---|
|
File-size distribution |
Whether the table contains excessive small files |
|
Metadata/planning time |
Whether discovery and planning are becoming expensive |
|
Query workload |
Which tables and partitions deliver the greatest optimization value |
|
Update and delete patterns |
Where rewriting or delete-file handling is necessary |
|
Maintenance cost |
Whether optimization produces a net economic benefit |
These signals can guide a workload-aware maintenance policy.
For example, a heavily queried table with poor file organization may justify frequent optimization. A rarely accessed historical table may not.
Similarly, a table with frequent updates may require a different maintenance schedule from an append-only analytical dataset.
The framework is a proposed engineering approach, not a claim of a novel algorithm or experimentally proven performance improvement.
How to Test the Framework
A reproducible evaluation could compare three strategies.
Baseline A — No proactive optimization: Retain normal ingestion behavior and measure the resulting query and storage characteristics.
Baseline B — Fixed-schedule maintenance: Run compaction and metadata maintenance at a predefined interval.
Strategy C — Workload-aware maintenance: Trigger optimization based on observed file distribution, planning time, query frequency, and estimated maintenance cost.
The experiment should use identical data, query workloads, compute configurations, and table-format versions.
Important measurements include query latency, planning time, object-storage operations, maintenance runtime, bytes rewritten, storage usage, and total cost.
A useful economic measure is:
Net optimization value = avoided query cost − maintenance cost − additional storage cost
This simplified expression is not sufficient by itself to account for reliability and SLA requirements, but it provides a starting point for cost analysis.
The purpose of the experiment would be to establish when proactive maintenance is beneficial and when it merely adds overhead.
Governance Also Depends on Metadata Quality
Metadata is not only a query-optimization concern.
Catalog consistency, schema history, ownership, lineage, and retention policies influence how confidently organizations can use lakehouse data.
As analytical systems become inputs to AI applications, the consequences of unreliable metadata become more significant.
A data product may be physically available but operationally unsuitable if consumers cannot determine its freshness, provenance, or schema compatibility.
This suggests that metadata performance and metadata governance should be managed together.
The Next Lakehouse Optimization Frontier
The most important lakehouse optimization opportunities are not always in the query engine.
They may be in the systems that decide which files exist, how tables evolve, which snapshots remain necessary, and how workloads interact with stored data.
Lakehouse platforms should be designed around the lifecycle of data and metadata, not only the initial ingestion path.
A scalable lakehouse is one where storage growth does not automatically produce uncontrolled growth in planning overhead, maintenance cost, and operational complexity.
The next optimization question should be:
Are we managing the physical and metadata structure of the lakehouse as deliberately as we manage its compute?
